Machine fault detection with a model that learns on the microcontroller itself

The unit listens to the machine's sound and vibration while it's healthy and learns its normal pattern on the board itself, with no server or internet. After that, any change in vibration or sound is flagged as a sign of an upcoming fault before the machine stops.

The problem

Preventive maintenance follows a fixed schedule, say every three months, whether the machine needs it or not — so you either pay for unnecessary maintenance or suffer a sudden breakdown between visits. Commercial solutions upload data to a cloud service, which is costly and needs a network in places that may not have one.

How it works

  1. LearningThe unit records the machine's vibration and sound while healthy for a period of time.
  2. BuildingA small model representing the normal state is built on the board.
  3. MonitoringEvery new reading is compared with the model.
  4. AlarmRepeated deviation triggers an alert before the full failure happens.

Project features

  • Learning happens on the board itself, so no data ever leaves the device.
  • It combines vibration and sound, because some faults only show up in one of them.
  • A clear on-site learning phase: run the machine while it's healthy so the model learns its state.
  • It works with no internet at all, which suits isolated workshops.

Expected challenges

These are the main obstacles to expect during the build, laid out clearly so you know them before you start.

  • If the model learns on a machine that's already faulty, it will treat the fault as normal.
  • A change in load or speed can look like an anomaly even though it isn't a fault.
  • The board's memory is limited, so the model must be very small.
  • How the sensor is mounted on the machine affects the reading more than any setting in the code.
